\## Executive Summary

Recent advancements in large language models (LLMs) have brought about challenges related to their computation and memory requirements, particularly as the amount of context they process increases. A new approach, known as the Boa Compressor, has been developed to address these challenges by effectively compressing context before it is used for inference. This innovation is particularly relevant for businesses that rely on LLMs for tasks requiring long context inputs, such as customer service automation, content generation, and data analysis.

Current methods for compressing context typically use the same architecture as the target model, leading to significant delays due to increased latency. This situation limits the effectiveness of compression techniques to offline scenarios, where context is compressed once and reused for multiple queries. The Boa Compressor offers a solution by utilizing a Mamba state-space model (SSM) that can compress arbitrary-length context in a single, efficient pass. This model enables real-time processing, significantly reducing the time taken to generate compressed representations.

The Boa Compressor operates by training the SSM through a process called distillation. In this process, the SSM learns to mimic the output of the original LLM when it processes full context. This allows Boa to produce compressed representations that maintain the quality of the output while being faster than traditional Transformer-based methods. In benchmarking tests, Boa has shown that it matches or even exceeds the performance of leading offline compression methods. Notably, it achieves this while being an order of magnitude quicker, which directly translates to lower latency during inference.

One of the standout features of the Boa Compressor is its scalability. It can handle longer contexts and achieve aggressive compression ratios, reportedly up to 16 times. This capability could make it a valuable tool for enterprises looking to deploy LLMs in scenarios where processing speed and efficiency are critical. For instance, organizations using LLMs for real-time customer interactions could benefit from reduced wait times, leading to improved customer satisfaction.

By enabling efficient compression that can be applied at inference time rather than as a pre-processing step, the Boa Compressor presents a practical solution for businesses that need to leverage LLMs without incurring substantial latency costs. This innovation could be particularly useful in sectors where rapid response times are essential, such as financial services, e-commerce, and real-time analytics.

In summary, the Boa Compressor represents a significant advancement in the management of context for LLMs, with potential applications that could enhance the efficiency of AI-driven services across various industries. Its ability to compress context on-the-fly while maintaining performance makes it a promising option for businesses looking to optimize their use of large language models.

\## Academic Abstract

Transformer-based large language models (LLMs) impose substantial computation and memory costs as context sizes increase, motivating methods that compress a context into a shorter representation before inference. Existing soft-prompt compression methods typically use the same Transformer backbone as used in the target model, where producing the compressed representation leads to significant latency overheads. This restricts them to the offline setting where context is compressed once and then reused across many queries. We propose the Boa Compressor, a plug-and-play online context compressor built on a Mamba state-space model (SSM) that encodes arbitrary-length context in a single linear-time pass, producing a representation on which we condition a frozen target LLM. The SSM is trained by distillation, matching the next-token logit distribution from the LLM ingesting the full context (as teacher) to the same LLM ingesting the compressed representation (as the student). At equal compression ratios, Boa matches or surpasses the performance of existing state-of-the-art offline compression baselines, while being an order of magnitude faster than Transformer-based implementations, thereby reducing end-to-end latency rather than adding compression time overhead. We demonstrate that Boa also scales well to longer contexts and to compression ratios as aggressive as 16x. By enabling effective compression that is cheap enough to run on every query at inference time, Boa becomes a practical and general tool for efficient long-context inference.
