\## Executive Summary

The research introduces Dwell, a new framework designed to enhance the capabilities of pretrained vision-language models (VLMs) in reinforcement learning settings. These models have significant potential since they already possess extensive world knowledge, but they often fall short when it comes to improving their decision-making through real-time interactions. This limitation arises because updating the model to reflect new experiences can be computationally intensive, creating challenges for efficient learning.

Dwell addresses these issues by reimagining how VLMs operate. Instead of treating them merely as static knowledge bases, Dwell utilizes them as dynamic components that can predict and adapt based on past experiences. This transformation allows the model to learn continuously from its interactions, predicting potential outcomes and refining its actions based on these insights. Essentially, Dwell combines the roles of a world model and a policy, enabling the agent not only to understand its environment but also to make informed decisions about its next steps.

The framework was tested across five different interactive visual environments. In these benchmarks, Dwell outperformed other trainable methods, demonstrating superior overall performance. Notably, it also significantly reduced the computational resources required for simulating potential future actions. This efficiency suggests that effective world models do not need to recreate every detail of future scenarios; instead, they must focus on anticipating outcomes that are beneficial for decision-making.

The implications of this research could be substantial for businesses that rely on AI-driven agents in complex environments. Industries such as robotics, customer service automation, and interactive gaming might find that integrating Dwell-like frameworks into their systems can lead to more responsive, adaptable agents. By leveraging existing models more effectively, companies could reduce costs associated with model training while enhancing performance outcomes in real-time applications.

The findings are based on simulation results, and while they present a promising direction for future development, real-world applications still require thorough testing and validation. However, the potential for Dwell to transform how AI agents learn from experience could lead to more efficient and intelligent systems across various sectors. The code for Dwell is publicly available, allowing interested parties to explore its capabilities further and integrate them into their own projects.

\## Academic Abstract

Learning from experience is essential for building the next generation of agents that continually expand their capabilities. Pretrained vision-language models (VLMs) already internalize rich world knowledge, yet this knowledge is rarely leveraged to drive policy improvement through online interaction. Realizing this potential efficiently remains challenging, as policy updates shift the agent's interaction distribution, requiring the world model to adapt accordingly, while continually updating large pretrained models is computationally expensive. To address this challenge, we introduce Dwell, a model-based reinforcement learning (RL) framework that reframes a VLM as a recurrent latent transition operator, endowing it with the ability to predict, adjust, and act in latent space. Leveraging the VLM's own representations and its dual role as both world model and policy, the agent continually learns from real interactions to anticipate and evaluate action outcomes, and from latent imagination to improve its behavior. Across five interactive visual environments, Dwell achieves the strongest overall performance among trainable methods while substantially reducing the compute required for imagination, showing that effective world models for VLM agents need not reconstruct the future; they need to predict futures that are useful for action.
