\## Executive Summary

The research proposes a new approach to enhancing safety in real-world reinforcement learning (RL) for robotics, particularly in tasks that involve physical interactions, such as manipulating objects. While RL has traditionally faced challenges in balancing learning efficiency with safety, the introduced framework, called Safe Evidential Real-World Reinforcement Learning (SEVI), aims to address these concerns.

SEVI incorporates an innovative component known as the Evidential Safety Critic. This critic assesses two critical factors during task execution: the risk of violating safety constraints and the level of uncertainty associated with that risk. By evaluating these factors in real-time, SEVI can decide whether to allow a proposed action by the robot or to intervene for safety.

The framework operates as follows: when the robot is about to execute a task, SEVI predicts whether the action is safe based on current evidence. If the prediction indicates a high risk of unsafe behavior or if the evidence is not robust enough, SEVI will override the robot's intended action. Instead, it directs the robot to follow a pre-trained recovery policy that steers it toward safer alternatives.

SEVI was tested in both simulated environments and real-world scenarios, specifically focusing on tasks related to object manipulation. Notably, one real-world task involved inserting a USB connector, which illustrates SEVI's applicability in tasks that require precise and careful handling. The evaluations demonstrated that SEVI outperformed existing approaches, achieving the best safety predictions and successfully completing tasks more often than alternatives. It notably reduced the occurrence of unsafe events by 13.4% to 57.1% compared to previous methods that relied on recovery strategies, all while maintaining quick response times.

The results come from both simulation-based tests and a practical application, highlighting SEVI's effectiveness across various conditions, including those that differ from the expected task environment. This adaptability is crucial for deploying robotic systems in unpredictable real-world settings, where safety is paramount.

In summary, SEVI represents a significant advancement in the field of robotic safety, making it possible for robots to learn and perform complex tasks while minimizing the risk of accidents. This framework could be particularly valuable for industries where robotic manipulation is becoming more prevalent, such as manufacturing, healthcare, and logistics. By integrating safety into the learning process, SEVI may pave the way for safer and more reliable robotic operations in everyday situations.

\## Academic Abstract

Real-world reinforcement learning has enabled contact-rich manipulation tasks to be trained directly on physical robots, but unsafe interactions during online learning remain a key barrier to practical deployment. We propose Safe Evidential Real-World Reinforcement Learning (SEVI), a framework for reliability-aware safety intervention during real-world policy learning. SEVI introduces an Evidential Safety Critic that estimates both future constraint-violation risk and epistemic uncertainty in a single forward pass. During online learning, SEVI evaluates each task-policy action before execution; if the action is predicted to be unsafe or the prediction is insufficiently supported by evidence, SEVI overrides it with an offline-trained recovery policy that guides the robot toward a lower-risk region. We evaluate SEVI on two simulated manipulation tasks and a real-world USB insertion task under in-distribution and distribution-shifted conditions. Across task-learning and safety-critic baselines, SEVI achieves the strongest trajectory-level safety prediction, the highest final task success, and the lowest unsafe-event counts. SEVI also reduces unsafe events by 13.4 to 57.1 percent relative to recovery-based safe RL while preserving low-latency execution-time filtering.
