\## Executive Summary

Recent research has introduced a new system called TIMERSI, designed to enhance the application of time-series forecasting models in real-world scenarios. While time-series foundation models demonstrate strong capabilities in generating forecasts without prior specific training on a task (known as zero-shot forecasting), practical deployment still requires adjustments to fit particular tasks. This adjustment often involves significant input and expertise, which can be a barrier for organizations seeking to implement these models effectively.

TIMERSI addresses this challenge by functioning as an agentic deployment system that improves the use of established forecasting models. The system includes a coding agent that interprets task descriptions and makes necessary alterations to the forecasting model's input and output pipelines. It conducts tests on historical data to evaluate how well these adjustments perform, focusing on identifying and correcting recurring forecast errors. This feedback loop allows TIMERSI to refine the forecasting process continuously.

During its operation, TIMERSI employs a mechanism to select the most effective pipeline based on completed forecasts that have occurred under similar conditions. This adaptive selection process helps ensure that the forecasting model remains relevant and accurate over time.

The research demonstrates that TIMERSI significantly outperforms other approaches across 198 tasks evaluated on benchmarking datasets known as TIME and FEV-bench. Specifically, it excels in both six-point forecasting and probabilistic forecasting metrics. The research also indicates that the feedback-guided revision process employed by TIMERSI is more effective than static, non-iterative methods of pipeline selection.

Additionally, the findings suggest that TIMERSI's framework can generalize across various coding agents and different forecasting models, indicating its versatility and potential applicability in diverse settings. These results stem from controlled experiments and simulations rather than from real-world deployments, which suggests the need for further testing in practical environments.

For businesses, the implications of TIMERSI are significant. By reducing the need for extensive human expertise in customizing forecasting pipelines, organizations may find it easier to leverage advanced forecasting models. This could lead to improved decision-making and operational efficiencies, especially in industries where accurate forecasting is critical, such as finance, supply chain management, and demand forecasting.

\## Academic Abstract

Time-series foundation models provide strong zero-shot forecast, but deployment for real- world applications still requires task-specific designs for model inputs and outputs. Direct inference can leave domain knowledge and re- curring forecast errors unaddressed, while tai- lored pipelines require substantial human ex- pertise and effort. We introduce TIMERSI, a self-improving agentic deployment system around frozen forecasting models. A cod- ing agent translates task descriptions into ex- ecutable pipeline changes. It tests each re- vision on historical forecasting windows and uses observed errors to guide subsequent re- visions. During deployment, an adaptive se- lector chooses among the resulting pipelines using completed forecasts under similar con- ditions. Across 198 tasks on TIME and FEV- bench, TIMERSI outperforms all submissions on six point and probabilistic forecasting met- rics. Controlled comparisons support the value of feedback-guided revision over non-iterative pipeline search. Further experiments verify the generalization with different coding agents and forecasting models.
